According to McKinsey's December 2025 COO100 Survey, manufacturing executives are allocating substantial budgets to AI — but the same data suggests they may be systematically underinvesting in the governance, data infrastructure, and organizational readiness that determine whether those investments scale beyond isolated pilots. That gap — between what AI can do in a controlled pilot and what it delivers in continuous production — is where most mid-market manufacturers are stuck.

The Workloads Leading the Shift

Not all AI workloads face the same scaling difficulty. Three workloads are consistently leading that push.

A fourth category is emerging. The failure mode is consistent across manufacturers. Then the organization tries to replicate it — on a second line, at a second plant, across a different product family — and the effort multiplies faster than returns.

According to Taazaa's March 2026 analysis of AI scaling in manufacturing, standardized data products are what fundamentally alter deployment speed. When data is not standardized, each new deployment requires manual cleaning and integration work. That overhead compounds across the network until the cost of scaling a successful pilot approaches the cost of building it from scratch each time.

What Production-Ready Infrastructure Requires

For manufacturers deploying scaled AI, the dependencies are specific.

ERP integration is non-negotiable for demand forecasting and order-driven workloads. Data quality, field standardization, and API accessibility all become prerequisites, not afterthoughts.

MES and shop floor data collection is the equivalent requirement for predictive maintenance and quality control. AI models need consistent, timestamped sensor and process data. Manufacturers running disconnected or manually-entered shop floor data face a data collection problem, not an AI problem.

Governance and standardized data products address the scaling bottleneck directly. According to Taazaa, organizations that invest in data products — defined, reusable data assets with clear ownership and quality standards — can run experiments across multiple sites without rebuilding the data pipeline each time. This is the structural difference between a portfolio of pilots and a scalable AI program.

Cybersecurity and OT access controls become materially more important as AI moves into the production environment. When AI systems interact with equipment — triggering maintenance alerts, adjusting scheduling, feeding robotic controls — the OT network exposure increases. Governance of system access and modification needs to evolve in parallel with AI deployment.

Workforce readiness is the dimension most often underestimated. Operators and planners who interact with AI outputs need to understand what the models are doing well enough to catch errors and raise exceptions. That capability gap extends deployment timelines significantly.

The Organizational Shift Pilots Do Not Test

Pilots are inherently protected environments. They run with elevated support, tolerate data inconsistency, and operate outside normal change management processes. Production deployment does not.

The manufacturers moving most successfully from pilot to production share a common characteristic: they treat AI deployment as an operational discipline, not a technology project. Process owners — not just data scientists — are accountable for AI performance. Model outputs are integrated into daily operational workflows, not reviewed separately. Governance structures that monitor model drift, data quality, and exception handling are owned by operations, not IT.

AI that operates inside production processes — scheduling, maintenance, quality, supply chain — is fundamentally an operations management problem. Organizations generating sustained value from AI are treating it that way.
